Title: | Detecção de falhas em processos químicos contínuos : uma abordagem via ensemble learning e inferência bayesiana |

Abstract: | Uma falha é um evento indesejado em qualquer operação em uma indústria química. A sua ocorrência pode causar perdas em segurança operacional, ambiental e econômica. Devido à complexidade dos processos químicos por um lado, e a disponibilidade de grandes massas de dados por outro, atualmente, é crescente o número de aplicações de sistemas de detecção de falhas baseados em dados históricos de processos. A Análise por Componentes Principais (PCA) é o principal método estatístico multivariado empregado com esse propósito. Porém, nenhuma técnica em particular é capaz de descrever qualquer processo químico por completo; desse modo, uma combinação de técnicas constitui-se em uma solução alternativa potencial para uma detecção de falhas mais eficiente. O objetivo do presente trabalho é investigar o uso combinado (ensemble learning) de três técnicas: PCA, Kernel PCA e PCA Dinâmico, através de uma abordagem via inferência Bayesiana. O estudo de caso é o benchmark Tennessee, o mais usual na comunidade de Engenharia Química em todo o mundo. Verificou-se, de modo quantitativo, a maior eficiência da abordagem baseada em ensemble learning via inferência Bayesiana, com o uso da métrica de monitoramento, taxa de detecções perdidas (Missed Detection Rate; MDR). A partir da análise dos resultados, observou-se que não há perda da capacidade de detecção do sistema combinado em relação àqueles individuais; a melhora significativa do desempenho, a partir da métrica taxa de detecções perdidas (Missed Detection Rate, MDR), principalmente para cinco de seis falhas de difícil detecção; com valores de MDR consideravelmente próximos a zero para quatro dessas falhas. Em resumo, foi possível verificar o ganho significativo ao se adotar um sistema combinado de detecção de falhas em relação aos modelos individuais. A maior certeza sobre a presença de uma falha é um fator crucial para pelo menos mitigar perdas em potencial em processos industriais. |
Abstract: | A fault is an unwanted event in any operation in a chemical industry. Its occurrence may cause safety, environmental and economic losses. Due to the complexity of chemical processes from one side, and the availability of very large data sets from the other side, the use of fault detection systems based on historical process data has increased. The Principal Component Analysis (PCA) is the main multivariate statistical method employed with this purpose. However, no particular technique is capable of describing any chemical process as a whole; thus, the combination of techniques constitutes in a potential alternative solution towards more efficient fault detection. The objective of this work is to investigate the combined use (ensemble learning) of three techniques, namely PCA, kernel PCA and dynamic PCA, through a Bayesian inference strategy. The case study is the Tennessee benchmark, which is the most usual in the Chemical Engineering community worldwide. The higher efficiency of the adopted approach was quantitatively verified by means of the monitoring metric called Missed Detection Rate (MDR). From the analysis of the results, it was observed that there is no loss of the detection capacity of the combined system in relation to the individual ones; the significant improvement in performance, from the metric Missed Detection Rate (MDR), mainly for five of six hard-todetect faults; with MDR values close to zero for four of these faults. In summary, it was possible to verify the significant gain when adopting a combined fault detection system in relation to the individual models. Greater certainty about the presence of a fault is a crucial factor in at least mitigating potential losses in industrial processes. |
